Cover Story: Neural networks (NNs) are very powerful function approximators, achieving super-human performance in a variety of tasks. However, under distribution shifts, they struggle to retain performance over previously learned skills. Sequential Bayesian inference provides a principled framework to update models given new data. We show a number of important caveats when working with sequential Bayesian inference over NN weights for continual learning. For example, applying exact sequential Bayesian inference is extremely difficult in practice. Also, by working with linear models, we show that, despite exact inference, we may still have poor performance with a misspecified model. We conclude that a more fruitful approach to continual learning is to model the data-generating process. View this paper
